Building a Production Chatbot with RAG
You are about to build the most commercially valuable AI application pattern of 2025-2026: a chatbot that answers questions using your own data.
Not a chatbot that hallucinates confidently. Not a thin wrapper around ChatGPT. A chatbot that retrieves specific passages from your documents, generates answers grounded in those passages, cites its sources, and gracefully declines when it doesn't know something. A chatbot that runs in production — with streaming responses, conversation memory, monitoring, and cost controls.
This chapter is an end-to-end tutorial. We start with nothing and end with a deployed, production-grade chatbot. Every architectural decision is explained. Every tradeoff is surfaced. By the end, you will have a working system and — more importantly — the understanding to modify it for any domain: customer support, internal knowledge bases, legal documents, medical records, religious texts, or product documentation.
PrabhupadaAI is a production chatbot built using the exact architecture described in this chapter. It answers questions about Vedic philosophy using the complete works of A.C. Bhaktivedanta Swami Prabhupada — 80+ books, thousands of lectures, and conversations spanning decades. The system uses FAISS with IVF100 indexing, achieves 0.24-second search across 50,000+ text chunks, caches frequent answers, and synthesizes responses with voice using ElevenLabs. Everything in this chapter was battle-tested on that system before being written here.
The Architecture: From Documents to Answers
Before writing a single line of code, let's understand the full system. RAG stands for Retrieval-Augmented Generation — a technique where you first retrieve relevant information from a knowledge base, then augment the AI's prompt with that information, so it can generate an answer grounded in your actual data rather than its training data.

Think of this like a brilliant research assistant. When you ask them a question, they don't answer from memory alone. They walk to the filing cabinet (vector database), pull out the three most relevant folders (retrieval), read through them quickly (context augmentation), and then give you a synthesized answer while pointing to the specific pages they used (citation). RAG gives an AI this same process.
Let's build each component.
Phase 1: Document Processing and Chunking
Loading Documents
Your chatbot is only as good as the documents it can access. The first step is loading your raw content into a structured format the system can process.
Common document types and their challenges:

Chunking: The Most Important Step You'll Get Wrong First
Chunking is splitting your documents into smaller passages that can be individually retrieved. This is the step where most chatbot projects succeed or fail, and the reason is counterintuitive: chunk size matters more than model choice.
Too large (2,000+ tokens per chunk): You retrieve a giant block of text that contains the answer somewhere in the middle. The LLM has to find the needle. Context is diluted with irrelevant content. Token costs increase.
Too small (50-100 tokens per chunk): You retrieve a sentence fragment that lacks context. "The answer is 42" without knowing the question. The LLM can't synthesize a coherent answer from sentence fragments.
The sweet spot for most applications: 300-500 tokens per chunk (roughly 200-350 words), with 50-100 token overlap between consecutive chunks.

Why overlap?
Without it, a question about "consequences of karma" might
miss the answer because the relevant sentences are split
across two chunks. Overlap ensures every idea appears in
at least one complete chunk.
Think of chunking like cutting a book into index cards. If you cut mid-sentence, the card is useless. If you cut at paragraph boundaries with some sentences repeated on adjacent cards, every card makes sense on its own. The overlap is redundancy that prevents information loss at boundaries.
Chunking Strategy: Recursive Character Splitting
The most robust general-purpose strategy is recursive character splitting — an approach that tries to split on the largest meaningful boundary first, then falls back to smaller ones:

Every chunk should carry metadata — information about the chunk that isn't part of the chunk's text but helps with retrieval and citation:

Phase 2: Embedding — Converting Text to Numbers
What Are Embeddings?
An embedding is a numerical representation of text — a list of numbers (called a vector) that captures the meaning of the text. Texts with similar meanings produce vectors that are close together in mathematical space.

The philosophy texts cluster together. The programming texts cluster together. When a user asks "What does the Gita say about duty?", the query embedding lands near the philosophy cluster, and the system retrieves those chunks.

For most production applications: OpenAI text-embedding-3-small offers the best balance of quality, speed, and cost. For maximum quality: Voyage AI voyage-3-large consistently scores highest on retrieval benchmarks. For zero ongoing cost: nomic-embed-text runs locally.
PrabhupadaAI uses OpenAI's embedding model for indexing 50,000+ chunks. The total embedding cost for the entire corpus: approximately $2.40. Embedding is a one-time cost (you re-embed only when documents change). The recurring cost is in retrieval (query embedding) and generation — we'll calculate those later.

Phase 3: Vector Storage — Where Embeddings Live
What Is a Vector Database?
A vector database is a database optimized for storing and searching high-dimensional vectors. Unlike a traditional database that matches exact values (WHERE name = 'Krishna'), a vector database finds the vectors closest to a query vector — a nearest neighbor search.

For this tutorial, we use FAISS (Facebook AI Similarity Search) — the same library used in PrabhupadaAI. It is free, runs locally, and is blazingly fast.
FAISS Indexing: IVF for Speed
When you have 50,000 vectors and a user sends a query, you could compare the query vector against all 50,000 vectors (called a brute-force search). This works but scales poorly. At 1 million vectors, each query takes hundreds of milliseconds.
FAISS solves this with IVF (Inverted File Index). The concept:
- Cluster all your vectors into groups (called Voronoi cells). With IVF100, you create 100 clusters.
- At query time, first determine which clusters are closest to the query vector.
- Search only within those clusters — typically 5-10 out of 100.

Brute force: compare query to all 50,000 vectors → ~2.5 seconds
IVF100, nprobe=10: compare to ~5,000 vectors → 0.24 seconds
PrabhupadaAI's production configuration: FAISS with IVF100 index, nprobe=10 (search 10 clusters per query), 50,000+ vectors of dimension 1536. Average search time: 0.24 seconds. This is fast enough for real-time conversational use with streaming.
Phase 4: Retrieval — Finding the Right Context
When a user sends a query, the retrieval step is:
- Embed the query using the same embedding model used for indexing
- Search the vector database for the top-k most similar chunks (typically k=5 to k=10)
- Re-rank (optional but recommended) the results for relevance
- Filter based on metadata (optional — e.g., search only within a specific book)
The Re-ranking Step
Vector similarity is a blunt instrument. It finds chunks that are topically similar to the query, but not always the ones that answer the query. Re-ranking uses a more sophisticated model to reorder results by actual relevance.

Tools for re-ranking: Cohere Rerank, Voyage Reranker, or open-source cross-encoders like ms-marco-MiniLM. The re-ranking step typically adds 50-200ms but measurably improves answer quality.
Phase 5: Generation — The Augmented Prompt
Now you have the user's query and 5-10 relevant chunks. You construct a prompt that tells the LLM: "Answer the user's question using only the following context. If the context doesn't contain the answer, say so."
The System Prompt
This is the most important prompt you will write. It controls the chatbot's personality, accuracy, and safety:

The system prompt is like the training manual you give a new employee on their first day. It defines what they know, what they don't know, when to ask for help, and how to communicate. A vague training manual produces an unreliable employee. A precise one produces a consistent, trustworthy one.
Conversation Memory: Multi-Turn Context
Real conversations are multi-turn. Users ask follow-up questions that reference previous messages: "What about the second point?" "Can you explain that differently?" "How does that relate to what you said earlier?"
The Conversation Loop

Token Budget Management
Here's where multi-turn gets tricky. Every message in the conversation history consumes tokens from the model's context window. A 10-turn conversation about dense philosophical topics could easily reach 8,000-12,000 tokens of history — before you add the retrieved chunks and system prompt.
The token budget for a single generation call:

Strategies for managing history:
- Sliding window: Keep only the last N turns (typically 5-10). Simple and effective.
- Summarization: Every 5 turns, summarize the conversation into a single paragraph and replace the full history with the summary.
- Selective inclusion: For each new query, use an LLM to decide which past turns are relevant and include only those.
For most chatbots, the sliding window of 5-10 turns works well. Users rarely reference messages more than 5 turns back.
Guardrails: Preventing Hallucination and Staying On Topic
The Hallucination Problem
Even with RAG, LLMs can hallucinate — generate plausible-sounding statements that are not supported by the retrieved context. This happens when:
- The retrieved chunks are partially relevant, and the model "fills in" the gaps with its training data
- The model interprets the context creatively instead of literally
- The query is ambiguous, and the model picks a confident-sounding interpretation
Five Guardrail Techniques
1. Source-grounded prompting: Instruct the model to quote or paraphrase only from the provided context. Include an explicit instruction: "If you cannot find the answer in the context passages, respond with 'I don't have that information in my sources.'"
2. Citation enforcement: Require every factual claim to include a source reference. If the model can't cite a source, it shouldn't make the claim.
3. Confidence scoring: Ask the model to rate its confidence (high/medium/low) based on how well the context supports the answer. Surface low-confidence answers differently in the UI — with a warning or a suggestion to verify.
4. Topic boundaries: Maintain a list of in-domain and out-of-domain topics. If the query is about cooking and your chatbot is about Vedic philosophy, the system prompt should redirect.
5. Human escalation: For certain query types — complaints, legal questions, medical advice, safety concerns — the chatbot should immediately escalate to a human. Build a classification layer that detects these categories and routes them appropriately.

Streaming Responses: Perceived Speed with SSE
A production chatbot must stream its responses. Waiting 3-5 seconds for a complete response to appear feels broken. Watching text appear word-by-word feels fast and engaging — even if the total generation time is the same.
SSE (Server-Sent Events) is the standard technique. It's a one-directional HTTP connection where the server pushes incremental data to the client:

Streaming is like watching a page print line by line on a dot-matrix printer versus waiting for a laser printer to warm up and spit out the full page at once. The dot-matrix is technically slower total, but you see progress immediately — and that changes the experience from "is it broken?" to "it's working." Every major chatbot (ChatGPT, Claude, Gemini) streams responses for this reason.
On the frontend, you consume SSE with the EventSource API or the fetch API with a ReadableStream:

You cannot improve what you do not measure. Chatbot evaluation has three dimensions:
1. Retrieval Quality
Are you finding the right chunks? Measure with:
- Recall@k: Of all the relevant chunks in the database, what fraction appears in the top-k results? If the answer is in chunk #47 but you only retrieve the top 5, recall is 0%.
- Precision@k: Of the k chunks you retrieved, how many are actually relevant? Retrieving 5 chunks where only 1 is useful = 20% precision.
- MRR (Mean Reciprocal Rank): Where does the first relevant result appear? If it's the first result, MRR = 1. If it's the third, MRR = 0.33.
Build a test set: 50-100 questions with known correct source passages. Run retrieval against this test set and measure metrics weekly.
2. Generation Quality
Is the answer correct, complete, and well-cited? This is harder to automate, but two approaches work:
- LLM-as-judge: Use a separate LLM (ideally a different provider than your generation model) to evaluate answers on a rubric: accuracy (1-5), completeness (1-5), citation quality (1-5), helpfulness (1-5).
- Human evaluation: For the first 100 conversations, have a domain expert review every answer. Mark each as correct, partially correct, incorrect, or hallucinated. This establishes your quality baseline.
3. Hallucination Rate
The most critical metric. For every answer, check: Is every factual claim supported by the retrieved context?
A simple automated check:

Monitoring and Alerting
In production, you need visibility into four things:
- Latency: Time to first token, total response time. Alert if p95 exceeds 2 seconds to first token.
